Approximate Query Processing (BlinkDB-Style)

HeliosDB Full plans approximate query processing for interactive analytics on large tables: aggregate queries answered from stratified samples with a stated confidence interval, so analysts can trade exactness for response time and refine the answer when they need to. Approximate and probabilistic queries are on the roadmap and not in the current release of HeliosDB Full.

Planned: approximate and probabilistic queries are on the roadmap. Read the documentation.

Problem Being Solved

The Core Challenge

Analytical queries on large datasets are fundamentally slow:

  • Interactive Blocked: Analysts wait, lose context, make fewer discoveries
  • Cost Prohibitive: Cloud compute bills scale with data size
  • Decision Paralysis: Too slow to explore → decisions based on gut, not data

Why This Problem Persists

Traditional databases are designed for exactness, not speed:

  • Every row must be processed for SUM/AVG/COUNT
  • No native sampling infrastructure
  • No error bound calculation
  • No progressive result refinement
  • Architecture assumes "accuracy > latency"

But for most analytical questions, "close enough, fast" beats "exact, slow".

HeliosDB's Unique Solution

Key Capabilities

  • BlinkDB-Style Sampling: Multi-dimensional stratified samples maintained automatically
  • Error Budget Queries: Specify acceptable error, system optimizes for speed
  • Statistical Guarantees: Confidence intervals on all approximate results
  • Online Aggregation: Progressive results with narrowing error bounds
  • Automatic Sample Maintenance: Samples updated as data changes
  • Query-Specific Optimization: Sample selection based on query predicates

Concrete Business Examples

Example 1: E-Commerce - Real-Time Revenue Analytics

Scenario: Online retailer with 50B transaction records needs real-time revenue dashboards.

Problem: Executives refresh dashboards once per day because queries are too slow. Decisions based on stale data.

-- Enable approximate query processing
SET helios.approximate_query = true;
SET helios.error_budget = 0.02;  -- 2% error acceptable
SET helios.confidence_level = 0.95;  -- 95% confidence

-- Create stratified samples for common query patterns
SELECT helios_create_sample('transactions',
    sample_name => 'txn_sample_region_product',
    sample_rate => 0.01,  -- 1% sample
    stratify_by => ARRAY['region', 'product_category', 'DATE_TRUNC(''month'', txn_date)'],
    maintain_automatically => true
);

SELECT APPROXIMATE
    region,
    product_category,
    SUM(revenue) as total_revenue,
    COUNT(*) as transaction_count,
    AVG(revenue) as avg_order_value
FROM transactions
WHERE txn_date >= '2024-01-01'
GROUP BY region, product_category
ORDER BY total_revenue DESC;

-- Results with error bounds:
-- region    | category    | total_revenue         | txn_count        | avg_order

-- For exact answer on specific slice (when needed)
SELECT EXACT
    SUM(revenue)
FROM transactions
WHERE region = 'North' AND product_category = 'Electronics'
  AND txn_date >= '2024-01-01';

Example 2: Financial Services - Risk Analytics

Scenario: Investment bank calculating Value-at-Risk (VaR) across 500M positions.

Problem: Risk team can only run VaR once per day. Market moves faster than their analysis.

-- Create samples optimized for risk calculations
SELECT helios_create_sample('positions',

-- Progressive refinement for critical desks
SELECT APPROXIMATE WITH PROGRESSIVE
    desk,
    var_99,
    var_95
FROM positions p
JOIN daily_returns r ON p.security_id = r.security_id
WHERE desk = 'Derivatives'

Example 3: Ad Tech - Campaign Performance Analytics

Scenario: Ad platform with 2 trillion impression events needs real-time campaign optimization. Exact aggregations impossible.

Problem: Campaign managers can't see performance until next day. Wasted ad spend on underperforming campaigns.

Example 4: Healthcare - Population Health Analytics

Scenario: Health system with 50M patient records and 10B clinical events needs real-time cohort analysis for care management.

Problem: Epidemiologists wait hours for cohort queries. Outbreak response delayed.

-- Create samples for clinical analytics
SELECT helios_create_sample('clinical_events',

Example 5: Telecom - Network Analytics

Adoption Strategy

Phase 1: Sample Creation (Week 1)

  • Identify high-value analytical queries
  • Create stratified samples for common dimensions
  • Baseline exact query performance

Phase 2: Query Migration (Week 2-3)

  • Convert dashboards to approximate queries
  • Set appropriate error budgets per use case
  • Validate results against exact queries

Phase 3: Interactive Analytics (Month 2)

  • Enable ad-hoc approximate queries
  • Train analysts on error interpretation
  • Build confidence in approximate results

Phase 4: Full Deployment

  • Default to approximate for exploratory queries
  • Use exact only for financial reconciliation
  • Monitor and tune sample strategies

Technical Differentiators

  • BlinkDB-Style Sampling: Multi-dimensional stratification with variance optimization
  • Statistical Guarantees: Confidence intervals, not just "approximate"
  • Online Aggregation: Progressive results with narrowing bounds
  • Error Budget Queries: Specify accuracy, system optimizes speed
  • Automatic Maintenance: Samples stay fresh as data changes
  • Query-Adaptive: Sample selection based on predicates

Performance depends on workload and hardware. Published figures are measured on representative fixtures; see the benchmarks page and reproduce them on your own workload.
